Retrieval-Augmented Reinforcement Learning for Multi-Hop Reasoning in Small Language Models

This paper examines retrieval-augmented reinforcement learning as a systems strategy for improving multi-hop reasoning in small language models. Small language models are attractive because they can be deployed at lower cost, with lower latency, and under tighter governance than large centralized systems, but they often struggle to connect evidence across multiple documents and reasoning steps. Retrieval augmentation addresses some of this limitation by supplying external evidence, while reinforcement learning offers a mechanism for aligning retrieval decisions, intermediate reasoning paths, and final answers with task objectives. The paper develops a system-level analysis of this combination, focusing on architecture, training trade-offs, inference behavior, infrastructure, sustainability, robustness, fairness, and policy. It argues that multi-hop reasoning in small models should not be treated as a single model capability but as a socio-technical pipeline involving retrievers, rankers, controllers, verifiers, memory systems, data governance, and human oversight. The analysis shows that retrieval-augmented reinforcement learning can improve evidence grounding and compositional reasoning, yet it also introduces new failure modes, including retrieval poisoning, reward hacking, compounding error, hidden cost shifts, and inequitable access to fresh knowledge. The paper concludes that responsible deployment requires transparent evaluation, auditable retrieval sources, energy-aware serving, domain-specific validation, and governance arrangements that treat knowledge infrastructure as a public and organizational asset rather than a purely technical component.
